AlphaDraft is an advanced Neural Draft Assistant for Dota 2, inspired by the AlphaZero architecture. Unlike traditional win-rate predictors that rely on player MMR or in-game statistics (which causes data leakage), AlphaDraft strictly uses pure draft semantics (Hero IDs and Roles) to evaluate tactical synergy and counter-picks.
It successfully identifies the intrinsic entropy ceiling of MOBA drafts (~56% AUC) and utilizes a Multi-Task Transformer to bridge human imitation learning with value-driven optimal recommendations.

The core of AlphaDraft is the DotaMultiTaskTransformer. It leverages a shared multi-head attention backbone to extract global synergy, decoupled into specialized predictive heads:

HeroEmbedding+SideEmbedding(Radiant/Dire) +WinToken(CLS-style global token). - Transformer Encoder: Captures long-range, non-linear hero synergies (e.g., global combos, specific counter-picks) that traditional tree models (like XGBoost) fail to capture.

RoleHeadto predict positional probabilities (1 to 5). It aligns hero features into structured tactical slots usingtorch.bmm, allowing the model to understand the semantic difference between a "Mid Tiny" and a "Support Tiny". - Decoupled Heads:

AlphaDraft is designed for the rigorous constraints of a 5v5 pure draft environment:

For any given drafting phase, the model outputs:
- Top 10 Hero Recommendations: Tailored to the current team composition and specifically targeting the enemy's weaknesses.
- Expected Win Rate (V-value): Each recommended hero is sorted not by how "popular" they are, but by the absolute win-probability advantage they bring to the draft.
To avoid the exponential explosion of standard Monte Carlo Tree Search (MCTS) in a 124-hero action space, we employ an AlphaZero-inspired One-Step Value Evaluation (Beam-Value Search):

In MOBA games, a draft is built sequentially. AlphaDraft elegantly handles partial states (e.g., Pick 3 of 10) through Masked Latent Expectation:

Unknown Hero (ID=0)token. - Through the Self-Attention mechanism, the Transformer implicitly calculates the expectation over all future possible hero selections based on the training data distribution.

WinHeadmaintains a highly competitive AUC (0.543) even on incomplete sequences, proving it acts as a robust State Evaluator without the need for exhaustive future path rollouts.
Traditional literature often claims 80%+ win prediction accuracy by "leaking" player skill data. In a pure, blind draft setting, the theoretical maximum predictability (Intrinsic Entropy Ceiling) is widely recognized in the industry to be around 55% - 57% (as most matchmaking enforces 50/50 balance).

AlphaDraft outperforms traditional gradient boosting by capturing Role-based Synergy, proving that positional context is mathematically critical in MOBA drafts.
To evaluate the true predictive power of the model, we employ a bucketed calibration analysis. Instead of looking solely at global accuracy, we group the test set predictions by the model's confidence level to see if its expected win probability aligns with the empirical reality.

*Note: Bins >60% contain statistically insignificant sample sizes ($N < 50$). Matchmaking systems naturally prevent drafts with such extreme inherent advantages, making these edge cases highly susceptible to in-game variance (e.g., player disconnects, critical misplays).
While the global baseline accuracy sits at ~55.8%, our Bucketed Accuracy Analysis reveals the model's true tactical depth:
- Perfect Calibration in the Core Distribution: The vast majority of Dota 2 drafts (~97.5%) are inherently balanced. Within the 50% to 57% confidence range, AlphaDraft acts as a highly precise evaluator, with its empirical accuracy tracking the expected probability within a remarkable < 0.5% margin of error.
- Identifying Tactical Alpha: Crucially, in asymmetric drafts where AlphaDraft identifies a distinct advantage (the 57-60% bracket), the actual empirical win rate surges to 60.59%, outperforming the model's own conservative expectation.
This proves that the WinHead is not suffering from overconfidence or random guessing. When AlphaDraft claims a lineup has a structural advantage, it successfully isolates genuine, game-deciding draft synergies that translate to real-world victories.
AlphaDraft demonstrates that while the overarching outcome of a Dota 2 match is heavily dominated by in-game stochasticity and mechanical skill, a faint but decisive tactical signal exists within the draft phase.
By decoupling imitation learning (MaskHead) from value estimation (WinHead), AlphaDraft achieves something extraordinary: It understands how humans draft, but recommends the mathematically optimal counter-pick that humans often miss. It is a step toward true AI-assisted tactical coaching in high-dimensional imperfect information games.
